The second, still in development, used a smaller, energy-efficient Raspberry Pi Zero twi watts (W) with a no infrared filter (NoIR) camera for nocturnal use.

The software included Raspberry Pi operating system (OS), Open computer vision (CV) for image processing, and TensorFlow Lite for AI detection. Upon motion detection, the system captured frames, classified images, and sent alerts via email or message queuing telemetry transport (MQTT).

Tests showed Raspberry Pi Zero was more energy-efficient, using 0.65W when idle and 2.65W during inference. The system processed images in under two seconds, ensuring quick responses and cost-effective performance.

Adapting AI Models for Field Use

Initial model performance in real-world settings often deviated from validation results due to environmental differences. To address these issues, the researchers implemented on-device continual learning, which allowed the AI models to adapt to new data specific to the camera's location. Field tests of a smart camera trap, equipped with a SqueezeNet model trained on Dataset I, were conducted in the Sierra de Aracena Natural Park. When applied to images from the field (Dataset II), the model showed reduced performance with low precision and accuracy due to environmental challenges such as varying illumination and vegetation. The researchers used explainable AI techniques like gradient-weighted class activation mapping (Grad-CAM) to identify the causes of false positives, such as the AI mistakenly interpreting vegetation as animals and false negatives due to difficult-to-detect animal positions.

To address these issues, the researchers proposed and tested a method that included on-device training and continual learning. On-device learning involved training the model with location-specific data, while continual learning updated the model with new data to adapt to changing conditions.

Preliminary tests with synthetic datasets and continual learning improved precision and recall, but challenges like data drift remained. Hyper-parameter tuning was performed to optimize training efficiency and performance on embedded devices.
